Across daily life, more decisions are being guided by prediction. Algorithms estimate the risk of fraud, forecast economic growth, flag suspicious transactions, and help prioritize public services. The results can look impressively precise. But the reasons behind them are often unclear, even to the people deploying the systems. This gap is becoming a central challenge for policy makers, businesses, and the public: a world that feels more predictable, but harder to understand.

Prediction has become a kind of infrastructure.

In economics, machine learning is increasingly used for “nowcasting” — estimating current conditions before official statistics arrive. A recent International Monetary Fund working paper describes machine-learning approaches that combine non-traditional data, including satellite data, to estimate economic activity when standard indicators are missing or delayed. These systems aim to support quicker decisions, especially where timely GDP-like measures are limited.

But speed and accuracy do not automatically produce clarity. When models draw on many signals at once, it can be difficult to explain what drove a specific forecast. That matters when forecasts influence high-stakes actions, such as changes in public spending assumptions, private investment plans, or risk controls.

A parallel trend is visible in finance research. New work on recession nowcasting shows an active push to make model decisions more interpretable, using explanation techniques such as Shapley-value methods to break down which variables contributed to a given prediction. The point is not only whether a model is “right,” but whether its reasoning can be audited and challenged.

## A growing “black box” problem

Many modern prediction systems are built from complex model families. They can include large ensembles, deep learning architectures, or general-purpose models adapted to specific tasks.

These systems can perform well, but they are often difficult to summarize with a simple story like “X causes Y.” Instead, they learn patterns from data that may be incomplete, biased, or shaped by past decisions.

In policing, this has been a longstanding concern. Research and policy reviews have warned that predictive policing tools can amplify biases in historical crime data and can be hard to scrutinize when vendors do not disclose model details. Missing data and uneven reporting can further distort estimates, raising the risk that predictions reinforce the very patterns they claim to detect.

The result is a tension that shows up across sectors: the model can produce a usable forecast, yet still fail a basic accountability test — explaining what it is doing, why it is doing it, and how it could be wrong.

## Regulation turns toward transparency

Regulators are increasingly treating explainability and transparency as core governance issues.

In the European Union, the AI Act is being phased in over several years. Governance rules and obligations for general-purpose AI models became applicable in August 2025. Another major milestone is August 2026, when a set of transparency obligations is due to apply, including requirements tied to certain AI systems that interact with people or generate synthetic content.

Separately, the Council of Europe opened for signature in September 2024 what it describes as the first legally binding international treaty focused on AI and alignment with human rights, democracy, and the rule of law. Its structure reflects a broader shift: AI oversight is moving beyond voluntary ethics statements toward formal requirements and enforceable duties.

In the United States, transparency is also being pushed through state-level rules and federal proposals.

California’s AB 2013, signed in September 2024, took effect on January 1, 2026. It requires developers of certain generative AI systems intended for public use in California to publish high-level information about the training data used.

At the federal level, a bill titled the Reliable Artificial Intelligence Research Act of 2025 was introduced in Congress with an emphasis on advancing interpretability research relevant to widely used AI products.

These efforts differ in scope and enforcement, but they share a common assumption: prediction systems will be used at scale, and the public interest requires more visibility into how they are built and deployed.

## The technical race to explain predictions

A fast-growing research field aims to make complex models more interpretable without sacrificing performance.

One popular family of approaches uses “feature attribution” methods, which estimate how much different inputs contributed to a specific output. These tools can help analysts understand why a forecast changed from one month to the next, or why a particular case was flagged.

Yet explainability tools have limits. A model can be “explained” in a technical sense while still being confusing to a non-expert user. And some explanations can mislead if they are treated as causal proof rather than descriptive clues.

This is why many governance frameworks emphasize practical risk management: documentation, evaluation, monitoring, and human oversight, not just a one-time explanation.

## What this means in everyday life

For most people, the shift is not abstract. It shows up when a bank blocks a transaction, when a platform prioritizes certain posts, when a call center routes a complaint, or when an agency ranks applications.

The broader pattern is clear: societies are building more systems that anticipate behavior and optimize responses. But unless those systems are understandable — and contestable — they risk eroding trust.

The next phase of AI governance is likely to be shaped by a basic question: if a model can reliably predict outcomes, what must it also do to help humans understand and responsibly act on those predictions?
